Neural Networks, Manifolds, and Topology

This is a very interesting perspective on neural networks, is it novel? I've never seen a geometric interpretation of NNs. In particular this: > (Apparently determining if knots are trivial is NP. This doesn’t bode well for neural networks.) Is there any theoretical research on obstructions to NN learning? Not that it would change much the practice (for instance, MLE learning of gaussian mixtures is NP-hard, but everybody does it anyway), but it could shed some light on the geometry of the "hard" instances. EDIT: for example, to get a sense of how ill-conditioned is deep NN learning, a recent paper [1] shows that if we feed to an object classifying NN an image with crafted but unnoticeable perturbations the predictions change completely.

Bloody brilliant. I have longed for a ML methodology that breaks out of the float vector representation because I don't think it describes naturally occurring problems that well, most ontologies are semi-structured. However, this really gets to the nub of the problem, real, but solvable, problems are manifold complexes. I don't think anyone has really built a learner for complexes though, persistent homology is a stab in the right direction but its not there yet IMHO.
则 Wy+b=W(x+av)+b=Wx+aWv+b=Wx+b。

I don't like his proof that a 1-2 hidden unit system can't handle the red circle in the blue torus. Feels too handwavy. My proof: Suppose the matrix W is singular. Then there exists a nonzero vector v for which W v = 0. Find a point x in the red circle, then find a different point y=x+av (for some scalar a) in the blue torus. Wy+b=W(x+av)+b=Wx+aWv+b=Wx+a0+b=wX+b. Fin.

Previously: https://news.ycombinator.com/item?id=7557964 https://news.ycombinator.com/item?id=9814114 But not a lot of discussion over there. The visualizations are great, and this basically blew my mind. I didn’t know of the manifold hypothesis until now. The manifold hypothesis is that natural data forms lower-dimensional manifolds in its embedding space. There are both theoretical and experimental reasons to believe this to be true. If you believe this, then the task of a classification algorithm is fundamentally to separate a bunch of tangled manifolds. My interpretation/rephrasing: if you want to build a neural network that distinguishes cat and dog pictures, in the worst case that would seem to require a huge network with many nodes/layers (say, the number being a function of the size of the image) rather than the number that seems to work reasonably well in practice (six or some other rather low constant number observed in reality). So the number of dimensions over which the “images” are potentially spread is huge, but it’d seem that in the real world one can rearrange the dog and cat images in a “shape” that then allows for relatively easy disentanglement by the neural network; and these shapes can probably be realized in much lower dimensions (in the example, six). This could explain (for some definition of explain) the observed predictive power of relatively small neural networks.
